Exploring the Boundaries of Diffusion Models for Offline Writer Identification with Sparse and Intra-Variable Data

Aritra Dey, Chandranath Adak, Kumari Priya, Soumi Chattopadhyay, Sukalpa Chanda

展开摘要

Offline writer identification poses significant challenges when training data is scarce, and handwriting styles exhibit high intra-writer variability. This scenario is common in practical applications such as forensic analysis and historical document authentication, where only a limited number of handwritten samples are available per writer. In this paper, we explore the viability of using diffusion models to capture writer-specific traits under such challenging conditions. Specifically, we investigate their performance in both text-dependent and text-independent setups, where lexical similarity varies across samples. We propose a novel diffusion-based writer identification framework that integrates a style encoder and handcrafted textural features in a joint training pipeline. Our approach is evaluated on a recent dataset with high intra-writer variability as well as three benchmark datasets (IAM, CERUG-EN, and CVL). Experimental results demonstrate that while diffusion models excel in text-dependent scenarios, their generalization capability diminishes in text-independent settings due to the entanglement of content and style features. This study highlights both the promise and the current limitations of generative diffusion models for fine-grained handwriting style modeling. We identify avenues for improving generalization through disentangled representations, domain adaptation, and hybrid discriminative-generative architectures. The proposed framework contributes to the growing efforts toward scalable, style-aware writer identification in real-world, unconstrained handwriting scenarios.

展开摘要

This paper tackles the problem of novel view acoustic synthesis along an arbitrary trajectory in an indoor scene, given the audio-video recordings from other known trajectories of the scene. Existing methods often overlook the effect of room geometry, particularly wall occlusions on sound propagation, making them less accurate in multi-room environments. In this work, we propose a new approach called Scene Occlusion-aware Acoustic Field (SOAF) for accurate sound generation. Our approach derives a global prior for the sound field learning through distance-aware parametric sound propagation modeling and then transforms it based on the scene structure learned from the input video. We extract features from the local acoustic field centered at the receiver using a Fibonacci Sphere to generate binaural audio for novel views with a direction-aware attention mechanism. Extensive experiments on the real dataset RWAVS and the synthetic dataset SoundSpaces demonstrate that our method achieves superior performance in spatial audio generation.

展开摘要

The rapid advancement of talking-head deepfake generation fueled by advanced generative models has elevated the realism of synthetic videos to a level that poses substantial risks in domains such as media, politics, and finance. However, current benchmarks for deepfake talking-head detection fail to reflect this progress, relying on outdated generators and offering limited insight into model robustness and generalization. We introduce TalkingHeadBench, a new benchmark designed to address this gap, featuring talking-head videos from six modern generators, with an additional two emerging generators used exclusively for testing generalization. The dataset is built on an expert-led curation process that filters over 60% of samples to remove videos with noticeable artifacts, presenting a more difficult challenge for detectors. Our evaluation protocols are designed to measure generalization across identity and generator shifts. Benchmarking seven state-of-the-art detectors reveals that models with high accuracy on older datasets like FaceForensics++ show a significant performance drop on our curated data, particularly at strict false positive rates (e.g., TPR@FPR=0.1%). In addition, we identify a trend where detectors focus on background cues instead of facial features using Grad-CAM visualization. Our benchmark aims to accelerate research towards more robust and generalizable detection models in the face of rapidly evolving generative techniques. We release our benchmark and dataset with all data splits and protocols at https://anaxqx.github.io/talkingheadbench.github.io.

展开摘要

Real-time 3D Gaussian Splatting (3DGS) has emerged as an efficient, high-fidelity alternative to neural radiance fields for novel view synthesis, enabling second-scale training and rendering via GPU rasterization. However, when input image collections contain transient disturbances (e.g., dynamic objects, exposure variations, motion blur) or suffer from sparse view coverage at scene boundaries, 3DGS performance degrades significantly due to reconstruction artifacts such as ghosting, floating points, and blurred surfaces. In this work, we present a unified framework that jointly addresses two types of artifacts: (1) corruption-driven artifacts, caused by transient or occluded content; and (2) information-limited artifacts, caused by insufficient multi-view observations. Our method leverages the training gradient signal, as well as the shape and spatial distribution of Gaussians, to adaptively suppress unreliable splats through a soft-masking strategy, without relying on any pretrained segmentation or feature networks.Extensive experiments on two real-world datasets with dynamic scenes and sparse camera trajectories demonstrate that our approach outperforms state-of-the-art robust 3DGS and uncertainty-pruning techniques in artifact suppression and reconstruction fidelity, while preserving real-time performance.

Virtually Unrolling the Herculaneum Papyri by Diffeomorphic Spiral Fitting

Paul Henderson

展开摘要

The Herculaneum Papyri are a collection of rolled papyrus documents that were charred and buried by the famous eruption of Mount Vesuvius. They promise to contain a wealth of previously unseen Greek and Latin texts, but are extremely fragile and thus most cannot be unrolled physically. A solution to access these texts is virtual unrolling, where the papyrus surface is digitally traced out in a CT scan of the scroll, to create a flattened representation. This tracing is very laborious to do manually in gigavoxel-sized scans, so automated approaches are desirable. We present the first top-down method that automatically fits a surface model to a CT scan of a severely damaged scroll. We take a novel approach that globally fits an explicit parametric model of the deformed scroll to existing neural network predictions of where the rolled papyrus likely passes. Our method guarantees the resulting surface is a single continuous 2D sheet, even passing through regions where the surface is not detectable in the CT scan. We conduct comprehensive experiments on high-resolution CT scans of two scrolls, showing that our approach successfully unrolls large regions, and exceeds the performance of the only existing automated unrolling method suitable for this data.

CSF-Net: Context-Semantic Fusion Network for Large Mask Inpainting

展开摘要

In this paper, we propose a semantic-guided framework to address the challenging problem of large-mask image inpainting, where essential visual content is missing and contextual cues are limited. To compensate for the limited context, we leverage a pretrained Amodal Completion (AC) model to generate structure-aware candidates that serve as semantic priors for the missing regions. We introduce Context-Semantic Fusion Network (CSF-Net), a transformer-based architecture that fuses these candidates with contextual features to produce a semantic guidance image for image inpainting. This guidance improves inpainting quality by promoting structural accuracy and semantic consistency. CSF-Net can be seamlessly integrated into existing inpainting models without architectural changes and consistently enhances performance across diverse masking conditions. Extensive experiments on the Places365 dataset demonstrate that CSF-Net effectively reduces object hallucination while enhancing visual realism and semantic alignment.

See, Think, Learn: A Self-Taught Multimodal Reasoner

展开摘要

Vision-Language Models (VLMs) have achieved remarkable progress in integrating visual perception with language understanding. However, effective multimodal reasoning requires both accurate perception and robust reasoning, and weakness in either limits the performance of VLMs. Prior efforts to enhance reasoning often depend on high-quality chain-of-thought (CoT) data, obtained via labor-intensive human annotations, costly proprietary models or self-training methods that overlook perception. To address these limitations, we propose a simple yet effective self-training framework called "See-Think-Learn" (STL). At its core, STL introduces a structured reasoning template that encourages the model to see before thinking: first extracting visual attributes in textual form, then using them to guide reasoning. The framework jointly improves perception and reasoning by having the model generate and learn from its own structured rationales in a self-training loop. Furthermore, we augment the training data with negative rationales, i.e. explanations that justify why certain answer choices are incorrect, to enhance the model's ability to distinguish between correct and misleading responses. This fosters more discriminative and robust learning. Experiments across diverse domains show that STL consistently outperforms baselines trained directly only on answers or self-generated reasoning, while qualitative analysis confirms the high quality of its rationales. STL thus provides a cost-effective solution to enhance multimodal reasoning ability of VLMs. Our code is available at https://github.com/srbhcs/see-think-learn.

FastHMR: Accelerating Human Mesh Recovery via Token and Layer Merging with Diffusion Decoding

Soroush Mehraban, Andrea Iaboni, Babak Taati

展开摘要

Recent transformer-based models for 3D Human Mesh Recovery (HMR) have achieved strong performance but often suffer from high computational cost and complexity due to deep transformer architectures and redundant tokens. In this paper, we introduce two HMR-specific merging strategies: Error-Constrained Layer Merging (ECLM) and Mask-guided Token Merging (Mask-ToMe). ECLM selectively merges transformer layers that have minimal impact on the Mean Per Joint Position Error (MPJPE), while Mask-ToMe focuses on merging background tokens that contribute little to the final prediction. To further address the potential performance drop caused by merging, we propose a diffusion-based decoder that incorporates temporal context and leverages pose priors learned from large-scale motion capture datasets. Experiments across multiple benchmarks demonstrate that our method achieves up to 2.3x speed-up while slightly improving performance over the baseline.

Uncertainty-Aware Subset Selection for Robust Visual Explainability under Distribution Shifts

Madhav Gupta, Vishak Prasad, Ganesh Ramakrishnan

展开摘要

Subset selection-based methods are widely used to explain deep vision models: they attribute predictions by highlighting the most influential image regions and support object-level explanations. While these methods perform well in in-distribution (ID) settings, their behavior under out-of-distribution (OOD) conditions remains poorly understood. Through extensive experiments across multiple ID-OOD sets, we find that reliability of the existing subset based methods degrades markedly, yielding redundant, unstable, and uncertainty-sensitive explanations. To address these shortcomings, we introduce a framework that combines submodular subset selection with layer-wise, gradient-based uncertainty estimation to improve robustness and fidelity without requiring additional training or auxiliary models. Our approach estimates uncertainty via adaptive weight perturbations and uses these estimates to guide submodular optimization, ensuring diverse and informative subset selection. Empirical evaluations show that, beyond mitigating the weaknesses of existing methods under OOD scenarios, our framework also yields improvements in ID settings. These findings highlight limitations of current subset-based approaches and demonstrate how uncertainty-driven optimization can enhance attribution and object-level interpretability, paving the way for more transparent and trustworthy AI in real-world vision applications.

展开摘要

Multimodal language models (MLLMs) demand immense parameter capacity to align high-dimensional visual features with linguistic representations, making them computationally heavy and difficult to deploy efficiently. We introduce a progressive reparameterization strategy that physically compresses these models by progressively replacing dense feed-forward network blocks with compact Parameterized Hypercomplex Multiplication (PHM) layers. A residual interpolation schedule, together with lightweight reconstruction and knowledge distillation losses, ensures that the PHM modules inherit the functional behavior of their dense counterparts throughout training. This transition yields substantial parameter and FLOP reductions while preserving strong multimodal alignment, leading to faster inference without degrading output quality. We evaluate the approach on vision-language models (VLMs). Our approach preserves strong performance comparable with base VLMs, while delivering substantial reductions in model size and inference latency. Progressive PHM substitution thus offers an architecture-compatible path toward more efficient multimodal reasoning and complements existing low-bit quantization techniques. SGPMIL: Sparse Gaussian Process Multiple Instance Learning

展开摘要

Multiple Instance Learning (MIL) offers a natural solution for settings where only coarse, bag-level labels are available, without having access to instance-level annotations. This is usually the case in digital pathology, which consists of gigapixel sized images. While deterministic attention-based MIL approaches achieve strong bag-level performance, they often overlook the uncertainty inherent in instance relevance. In this paper, we address the lack of uncertainty quantification in instance-level attention scores by introducing SGPMIL, a new probabilistic attention-based MIL framework grounded in Sparse Gaussian Processes (SGP). By learning a posterior distribution over attention scores, SGPMIL enables principled uncertainty estimation, resulting in more reliable and calibrated instance relevance maps. Our approach not only preserves competitive bag-level performance but also significantly improves the quality and interpretability of instance-level predictions under uncertainty. SGPMIL extends prior work by introducing feature scaling in the SGP predictive mean function, leading to faster training, improved efficiency, and enhanced instance-level performance. Extensive experiments on multiple well-established digital pathology datasets highlight the effectiveness of our approach across both bag- and instance-level evaluations. Our code is available at https://github.com/mandlos/SGPMIL.

MIX-based Foreground and Background Patch Augmentation Guided by Physics and Material Properties for X-ray Detection

Xintong Liu, Dongliang Chang, Yujun Tong, Zhanyu Ma

展开摘要

The performance of deep learning-based models for X-ray prohibited item detection heavily relies on large-scale, diverse datasets, which are often unavailable. While data augmentation offers a promising solution, prevalent methods ignore the fundamental principles of X-ray imaging, leading to artifacts such as distorted material properties and unnatural thickness perturbations. To bridge this gap, we present MIX, a physics-grounded data augmentation pipeline. The core idea of MIX is to manipulate image attributes in a way that reflects real-world physical variations. Our contributions are twofold: (1) To address material ambiguity, MIX modulates foreground pseudo-colors by directly manipulating hue and saturation, informed by the relationship between color and effective atomic number. This forces the model to learn more robust material representations. (2) To simulate variations in object density and thickness, MIX introduces a novel thickness perturbation technique based on X-ray attenuation principles. This significantly improves the model's adaptability to geometric changes. Our proposed method seamlessly integrates with existing detectors and yields substantial performance gains across multiple benchmarks. Our work not only provides an effective augmentation solution but also highlights the critical need for domain-specific approaches in X-ray computer vision.

展开摘要

Advances in 3D reconstruction and novel view synthesis have enabled efficient and photorealistic rendering. However, images for reconstruction are still either largely manual or constrained by simple preplanned trajectories. To address this issue, recent works propose generalizable next-best-view planners that do not require online learning. Nevertheless, robustness and performance remain limited across various shapes. Hence, this study introduces Voxel-Face-Aware Hierarchical Next-Best-View Acquisition for Efficient 3D Reconstruction (Hestia), which addresses the shortcomings of the reinforcement learning-based generalizable approaches for five-degree-of-freedom viewpoint prediction. Hestia systematically improves the planners through four components: a more diverse dataset to promote robustness, a hierarchical structure to manage the high-dimensional continuous action search space, a close-greedy strategy to mitigate spurious correlations, and a face-aware design to avoid overlooking geometry. Experimental results show that Hestia achieves non-marginal improvements, with at least a 4% gain in coverage ratio, while reducing Chamfer Distance by 50% and maintaining real-time inference. In addition, Hestia outperforms prior methods by at least 12% in coverage ratio with a 5-image budget and remains robust to object placement variations. Finally, we demonstrate that Hestia, as a next-best-view planner, is feasible for the real-world application. Our project page is https://johnnylu305.github.io/hestia web.

展开摘要

Existing structured pruning typically involves multi-stage training procedures that often demand heavy computation. Pruning at initialization, which aims to address this limitation, reduces training costs but struggles with performance. To address these challenges, we propose an efficient one-cycle structured pruning framework that integrates pre-training, pruning, and fine-tuning into a single training cycle without compromising model performance, referred to as the `one-cycle approach'. The core idea is to search for the optimal sub-network during the early stages of network training, guided by norm-based group saliency criteria and structured sparsity regularization. We introduce a novel pruning indicator that identifies the stable pruning epoch by measuring the similarity between evolving pruning sub-networks across consecutive training epochs. Additionally, group sparsity regularization helps accelerate the pruning process, thereby speeding up overall training. Extensive experiments on the CIFAR-10/100 and ImageNet datasets using VGGNet, ResNet, and MobileNet architectures demonstrate that our method achieves state-of-the-art accuracy while being one of the most efficient pruning frameworks in terms of training time. Our code is available at https://github.com/ghimiredhikura/OCSPruner.

展开摘要

Millimeter-wave radar offers a privacy-preserving and lighting-invariant alternative to RGB sensors for Human Pose Estimation (HPE) task. However, the radar signals are often sparse due to specular reflection, making the extraction of robust features from radar signals highly challenging. To address this, we present milliMamba, a radar-based 2D human pose estimation framework that jointly models spatio-temporal dependencies across both the feature extraction and decoding stages. Specifically, given the high dimensionality of radar inputs, we adopt a Cross-View Fusion Mamba encoder to efficiently extract spatio-temporal features from longer sequences with linear complexity. A Spatio-Temporal-Cross Attention decoder then predicts joint coordinates across multiple frames. Together, this spatio-temporal modeling pipeline enables the model to leverage contextual cues from neighboring frames and joints to infer missing joints caused by specular reflections. To reinforce motion smoothness, we incorporate a velocity loss alongside the standard keypoint loss during training. Experiments on the TransHuPR and HuPR datasets demonstrate that our method achieves significant performance improvements, exceeding the baselines by 11.0 AP and 14.6 AP, respectively, while maintaining reasonable complexity. Our code will be released upon publication.

展开摘要

With the rapid proliferation of AI-generated content (AIGC) on multimedia platforms, efficient and reliable video forgery detection has become increasingly important. Existing approaches often rely on either visual artifacts or semantic inconsistencies, but suffer from high computational costs, limiting their deployment at scale. In this work, we propose SVD-Det, a lightweight and efficient pipeline that leverages both semantic and Visual Defect cues to detect forged videos. SVD-Det fuses spatiotemporal representations from raw RGB frames and compression-induced distortions using a 3D-Swin Transformer, and augments semantic understanding via CLIP-based embeddings. To integrate these heterogeneous modalities, we introduce Domain-Query Attention (DoQA), a novel attention mechanism that hierarchically aggregates spatial and temporal features. Experiments across seven video generation domains demonstrate that SVD-Det not only achieves state-of-the-art detection performance but also reduces model size and inference time by over 97% and 98%, respectively, compared to LMM-based baselines. Our results highlight the practicality and robustness of SVD-Det for scalable AIGC detection in real-world scenarios.

GaussianHeadTalk: Wobble-Free 3D Talking Heads with Audio Driven Gaussian Splatting

展开摘要

Speech-driven talking heads have recently emerged and enable interactive avatars. However, real-world applications are limited, as current methods achieve high visual fidelity but slow or fast yet temporally unstable. Diffusion methods provide realistic image generation, yet struggle with one-shot settings. Gaussian Splatting approaches are real-time, yet inaccuracies in facial tracking, or inconsistent Gaussian mappings, lead to unstable outputs and video artifacts that are detrimental to realistic use cases. We address this problem by mapping Gaussian Splatting using 3D Morphable Models to generate person-specific avatars. We introduce transformer-based prediction of model parameters, directly from audio, to drive temporal consistency. From monocular video and independent audio speech inputs, our method enables generation of real-time talking head videos where we report competitive quantitative and qualitative performance.

AGENet: Adaptive Edge-aware Geodesic Distance Learning for Few-Shot Medical Image Segmentation

Ziyuan Gao

展开摘要

Medical image segmentation requires large annotated datasets, creating a significant bottleneck for clinical applications. While few-shot segmentation methods can learn from minimal examples, existing approaches demonstrate suboptimal performance in precise boundary delineation for medical images, particularly when anatomically similar regions appear without sufficient spatial context. We propose AGENet (Adaptive Geodesic Edge-aware Network), a novel framework that incorporates spatial relationships through edge-aware geodesic distance learning. Our key insight is that medical structures follow predictable geometric patterns that can guide prototype extraction even with limited training data. Unlike methods relying on complex architectural components or heavy neural networks, our approach leverages computationally lightweight geometric modeling. The framework combines three main components: (1) An edge-aware geodesic distance learning module that respects anatomical boundaries through iterative Fast Marching refinement, (2) adaptive prototype extraction that captures both global structure and local boundary details via spatially-weighted aggregation, and (3) adaptive parameter learning that automatically adjusts to different organ characteristics. Extensive experiments across diverse medical imaging datasets demonstrate improvements over state-of-the-art methods. Notably, our method reduces boundary errors compared to existing approaches while maintaining computational efficiency, making it highly suitable for clinical applications requiring precise segmentation with limited annotated data.

Video and Language Alignment in 2D Systems for 3D Multi-object Scenes with Multi-Information Derivative-Free Control

展开摘要

Cross-modal systems trained on 2D visual inputs are presented with a dimensional shift when processing 3D scenes. An in-scene camera bridges the dimensionality gap but requires learning a control module. We introduce a new method that improves multivariate mutual information estimates by regret minimisation with derivative-free optimisation. Our algorithm enables off-the-shelf cross-modal systems trained on 2D visual inputs to adapt online to object occlusions and differentiate features. The pairing of expressive measures and value-based optimisation assists control of an in-scene camera to learn directly from the noisy outputs of vision-language models. The resulting pipeline improves performance in cross-modal tasks on multi-object 3D scenes without resorting to pretraining or finetuning.

展开摘要

Maritime computer vision is a requirement for autonomous surface vehicles and can improve maritime safety if a high level of robustness is achieved. As deep learning dominates the computer vision community, domain-specific datasets are required to obtain well-generalizing and reliable models. However, maritime datasets, especially those containing videos and temporally dense annotations, are still small compared to other domains, such as autonomous driving or generic computer vision datasets. This paper introduces SeaClips, a new maritime video dataset containing 74 videos with an average duration of 14 seconds and with 31k frames in total. Videos were recorded under varying conditions, with three cameras mounted on shore and on boats. SeaClips provides frame-by-frame annotations, encompassing 129k bounding boxes of seven categories, containing vessel and non-vessel classes. SeaClips contributes to a broader coverage of maritime scenarios, leading to more robust computer vision models. Baseline results on the dataset are established by evaluating six image-based models and three models using temporal context, ranging from lightweight models to heavy transformer architectures. It is found that the different scales and shapes at which objects appear in SeaClips pose a challenge to state-of-the-art detectors. SeaClips is accessible for research on maritime obstacle detection at: https://huggingface.co/datasets/SEA-AI/SeaClips.
